Exploring GPT4 Gender Biases with Taylor Swift Lyrics

SHORT Demonstration of gender bias in GPT4, from various downstream task viewpoints.

tl;dr: LLMs are still representation of data encoded in the "society".

Disclaimer: I've no personal thoughts on what'd be the right way to "encode" society's language while avoiding bias.

Let's start with a basic task.

1. QA with ambiguous or unspecified answers

1A. If a girl and guy are disagreeing about household chores, it MOSTLY defaults to considering that the guy is the one not contributing enough.

1B. If a girl and guy are disagreeing about crying all the time, it SOMETIMES defaults to considering that the girl is the one crying all the time.

2. Biased Generation

2A. If you ask GPT4 to generate a story around a COUPLE having disagreements about household chores where the guy OR girl starts crying, it:

(a) Considers the guy to be the problem
(b) Considers it to be heterosexual relationship

2B. If you ask GPT4 to generate a story around a COUPLE having disagreements about crying where the guy OR girl starts getting frustrated, it:

Considers the girl to be the problem, to the point, where it mostly assigns the guy as frustrated even if stated otherwise!

3. Translation from a neutral language to a gendered language.

3A. The professor is teaching
3B. The student is teaching

Both default to male?

3C. The professor is dancing
3D. The student is dancing

Wait, is the default male in translation?

Now, a fair argument is "Even google translate does this".

Alright.

So, let's do something that Google Translate is careful about.

3E. Asking to translate just the entity. Translating professor still fails.

3F. Other examples for translation.

Are the translations just RLHF'ed to just be male?

It seems so because GPT3.5 gives the female output.

This is what I mean by, I do not have a personal idea on what would be "ideal" here.

4. Ambiguous pronoun references

4A. If the ambiguous reference is "SHE" between "server" and "chef", it MOSTLY picks them at a RANDOM.

4B. If the ambiguous reference is "HE" between "server" and "chef", it MOSTLY picks CHEF.

Main Idea: When assessing LLMs w/ prompts, not only do test datasets need iteration and versioning, so do the prompts.

What does usual model training look like?

1. We divide data into 3 categories: Train, Validation and Test
2. Pick the best model based on Validation
3. Report performance on Test set

Each of these "splits" have pre-established norms.

For example, the training split should be diverse, and heterogenous.

The validation and test split should not have any leakage or spurious correlations from the train split etc.

But when we are testing on closed LLMs, we do not know what went into the training dataset, and it is very likely, that the test dataset that we have or generate is now contaminated.

Add prompt based benchmarking to the mix, and we have another issue on our hands.

If we are not directly testing for "input sample"->"output", then how we write the prompt and what we ask for as an output significantly changes how we benchmark the ability of any model.

If all we have is observations, we need experimental design to "judge" any capability of a model.

We specifically need:
1. Controls
2. Experiments
3. Variables

A good way to do this is to define Prompt Based Experimental Design Schemas.

These are similar to templates, with one major difference:

They aim to not only vary the input sample, but also the prompt specifications and monitor changes from one prompt to another.

These have 4 major categories:
1. Prompts
2. Samples
3. Outputs
4. Metadata

Output evaluation or metric design is a complex problem of its own, whether we use prompt based systems or not. So, in this thread, we will touch upon schemas for the other three.

I will use the basic Theory of Mind example in the Sparks of AGI paper.

Let's go over these one by one:
1. Prompts

We define 3 types of steering in prompt:
A. Start
B. Process
C. Output

An output steer has two components:
C1. Instructions (Constraints and Format) &
C2. Options.

For example, the sparks of AGI paper has only a start steer.

We can modify it to have both a start steer and a process steer (Add the sentence "let's think about it step by step").

Going further, we can also add an output instruction steer. ("Respond only with the folder path and nothing else").

2. Sample

A sample has 2 components: A. Examples and B. Input.

We do not need examples if we aim for zero-shot prompting.

Examples can be A1. Positive or A2. Negative

Input has 3 parts: B1. Sample, B2. Question, and, B3. Concept

For example, in the Theory of Mind, False Belief Test, there are no examples. The prompt has a sample, question and an implicit concept.

We can annotate it as shown in the picture.

Which brings us to the last part of the proposed schema:
4. Metadata

The metadata has 5 parts:
A. Connectors
B. Iteration
C. Variation
D. Intuition
E. Experimental Design

A. Connectors

Connectors are internal to a single prompt. They A1. add, A2. negate, A3. except an information present in the prompt or being tested.

For example, "He says nothing about this to Alice, and Dropbox also does not notify Alice." is a reinforcement for belief.

B. Iteration

Iteration is changing the prompt, not the sample or the desired output.

Ex, adding the words "Let's think about this step by step" is an iteration with the aim of adding a "Process steer".

We define these as:
B1. Multi-instruction
B2. Rewording
B3. Chaining

C. Intuition

We define intuition as the "reasoning behind the prompt". For example, the researchers aim to test theory of mind, or false belief test using the prompt.

We define intuition as:

C1. Implicit
C2. Explicit
C3. Test

For example, in the Theory of Mind paper, we can discretize it as:

C1. Implicit (Theory of Mind)
C2. Explicit (Modernization -> Unseen Photos Because of Online Service)
C3. Test (False Belief Test)

Why do we care? Because we need to define concepts to define variations:

D. Variation

Variations are across input samples.

D1. Output Specification -> {Gen., Discriminative}
D2. Concept -> {Similar, Opposite, Control}
D3. Task -> {Objectivity -> [Subjective, Objective]}

Why does this matter? Because we cannot have any judgement of capability without a comprehensive enough variation set.

And here, we define the basics of the experiment and the corresponding prompt.

What would be a control? Control is a prompt that compares to a base model or a different kind of model where we can to the best of our knowledge say that the model does not exhibit certain capability.

For ex, if we can say that GPT3.5 does not "pass" false-belief test.

Previous prompt, Date and Model specify the testing environment and can be considered similar to controlled variables in any experimental design.

Previous prompt record allows us to (a) note the differences we made, (b) annotate those differences for iterations/concepts

The last part of this is directionality.

Defining "exact" specificity, ambiguity etc is hard.

But that is what we intuitively do. We write prompts to reduce ambiguity, for example.

The schema aims to codify direction of these variables as compared to last prompt.

For example, in this: we can believe that the model is correct and passes false-belief test.

But. Wait.

There is leakage. Using the word "think" or "believe" is a direct correlation with "belief-test".

Replacing it with "look for" makes it not work.

(L) Prompt in paper

Let's break down the prompt (look at img for details).

But there are basically 3 main concepts here:
1. Timing
2. "Unshared movement" of object
3. Implied "no knowledge transfer"

Note, while both gpt3.5 and gpt4 are correct here, gpt3.5 was not "completely correct" till a few days back.

Specifically, this was the output I got then, where in, the response implies she should check a SPECIFIC folder to verify whether the file was moved there.

Both GPT4 and GPT3.5 do reasonably well with hidden folder and files conditions.

Modifying the prompt for:

2. "Unshared movement/transformation" of object: renaming, renaming+undo

3. Implied "no knowledge transfer"

4. (NEW OBJECTIVE): Information movement: Syncing

Prompt Modification for Objective 4 continued:

Information Movement Manipulation: (Obstruction)

AND...

GPT4 fails BUT GPT3.5 succeeds?

Now, the only thing I can think of is people sending in their documents to train chat bot on.

What? Why? @random_walker thoughts?

Let's backtrack a bit. What if I dismissed some other "object transformation" that did cause issues?

Yes, I did.

2. "Unshared movement/transformation" of object: Moving all folders/files

GPT3.5 kinda reasons correctly but fails. GPT4 gets it right.

This is one of the best examples to show how it is predicting "how it should sound like next".

It is easy to take these examples and say, oh, gpt3.5 understands the concept of moving shared folders and files. But then it should not fail on the above prompt.

According to my mom, this is similar to Piaget's "The Preoperational Stage", aka, water in tall glass seems to be more than water in wide glass.

Now, that is not to say she agrees with all these theories, but man, has it been nice to hear non-crazy theories.

But we can take this prompt further.

The one major thing we have not changed yet is the reason for Implied "no knowledge transfer".

if I am inferring correctly, here it is "action taken by a localized agent on a shared online platform while the participant is uninformed"

Now, something that is very explicit in their prompt is, that Alice is "uninformed", i.e., she does not have the "awareness of transformation".

What if this "uninformed nature of activity was implicit". If a model does have real world understanding, it is inferable.

So, we try with the first

Lending: Implicit case of "NO knowledge transfer of actions of one participant to another" - lending [basic] and taking actions alone [reinforced notion]

Both GPT4 and GPT3.5 get it correctly.

So, does this prove that it has basic implicit concept of knowledge transfer possibility?

NOT SO FAST!

I cannot find the original tweet, but this did not use to work for gpt3.5.

It became popular and people fed it into the interface, so now, well you see...

Yup, BOTH GPT4 and GPT3.5 fail.

Hmm, why is the easier version correct?

Adding another "explicit" reasoning with "lending":

Math+Lending

For the first one, where the there are 2 steps of reasoning, both GPT4 and GPT3.5 fail

For the second one, where there is a single step of reasoning, GPT4 passes.

We can say something is learnt about "lending" being NO knowledge transfer of action between people.

How about trying for some other "implicit action".

Let's try "sleeping" and "going on vacation".

Spoilers: somehow both GPT4 and GPT3.5 fail to understand protocol here.

Task 1: Math (BASIC Subtraction) + Implicit "No knowledge transfer through sleeping" + External actor (Action taken by someone else and not self)

Both GPT4 and GPT3.5 fail on this simple task

Somehow sleep is not encoded as no knowledge transfer?

Let's try something else. Let's go back to the lending prompt that worked and see if excluding math makes the "sleep" implicit No knowledge transfer work.

It works!

So sleep may not be the problem?

Is it the "static object placement"+"constrained movement" that works?

Honestly, I wish these were reproducible. If serious eval can be twitch streams, what better way to engage and inform the public at the same time!

Alright, so.

This time about moving a key.

And both GPT3.5 and GPT4 get it right.

So, it is the Static object "placements" that is making it work, I think.

To make sure that is the case, let's modify the prompt again for:

Implied "no knowledge transfer" criterion -> Going on a vacation

Yes mom, I hear you, change only one variable at a time to have statistical validity in ANOVA comparisons later on.

Tell that to the 100 papers I reviewed last year that don't even adjust for multiple comparisons.

Alright, this time, just modifying the key problem for going on a vacation. Same boyfriend. No cats involved.

Now it works. So let's narrow that down.

"Explicit" movement to "explicit" location by "human actor" works?

Maybe it is the wording.

This time, I am changing the boyfriend to the cat again.

Well, "cat" as an "actor" changing "locations" does not produce the correct answer for GPT4 or GPT3.5.

Maybe maybe, if the cat did not drop all to the floor, it "placed" the keys on the floor?

Yay! GPT4 works here, and GPT3.5 does not.

Maybe the cat messes it up? GPT3.5 has been heavily RLHF'ed by humans for this purpose.

(I wish my cat carefully ever "placed" anything)

Going back to the original Alice and Bob prompt, remember where this all started?

The authors say: GPT-4 successfully passes the classic Sally-Anne false-belief test from psychology, leading to wikipedia mentions like the one on right.

Mom to the rescue.

Sally-Anne test specifically talks about: Answer is continuous with one actors perspective, but not with their own.

Yet GPT4 fails when the "action" to the answer "non-continuous" is not "explicit movement"

Summary:

Often GPT4 and sometimes GPT3.5 as of 4pm PT pass the Sally-Anne Test when:
(1) Action is explicit placement
(2) Action is explicit movement
(3) Non-Continuity can be due to implicit or explicit reasons

When do these fail?
(1) Action is implicit placement
(2) Action is implicit movement
(3) Makes shared modality assumption for Non-continuity as in the phonecall example.

That's my testing of Sally-Anne false-belief test. Someone please add a note to wikipedia page?

Creating Examples for Prompt Evaluation | Sally-Anne False-Belief Test

Alright, I was going to delay this till next week, but here we are, talking about some papers that dropped yesterday.

I am doing two thread today, one talking about the account and its future, and two, about the sparks of AGI paper (yes, we all know the one I am talking of)

I initially made this account last year to try merging my hobby of drawing with paper reading, two things I love.

But with a 3 year clinical depression that really inhibited my ability to complete anything, and the speed at which papers were being released, I gave up quickly.

As some of you might have seen, I have been active on this account again, for over a week now.

I needed to talk about NLP and LLMs without reading the same prompt hacks over and over again, and this seems like a good place.

I am not giving up on the purpose of this account.

I am going to instead be pivoting more towards interactive blogs kind of space (similar to @random_walker, but of course not at that scale).

So, I will mostly be sharing paper annotations, evaluation framework proposals etc.

Attributions are often claimed to possibly improve human "understanding" of the models, although little work explicitly evaluates progress towards this aspiration.

Researchers have proposed hundreds of techniques for attributing predictions to features that are deemed important to "explain" predictions of machine learning models.

But, the main question remains, are these techniques helpful for simulation or manipulation?

In this paper, the authors look at 3 different models, BERT ( Integrated Gradients & LIME for explanation), Bag Of Words (Linear Feature Coff. as explanation) and a linear student model (global cues & feature coff. as explanation), trained for Deception Detection.

Participants are asked to guess the prediction of the model, in presence (train) or absence (test) of the explanations, and then, manipulate the sample to flip the prediction.

Simulation Acc, % Flips and Confidence drops are used as evaluation metrics.

In conclusion, the study implies that simulation accuracy in absence of explanation is no better than random guessing, and linear feature coefficients including global weights, along with token highlights help effective manipulation.

Model rationalizations can either on sentence levels or token level. A rationalizer can either be posthoc or be built in, into the model. 

Robustness, on the other hand, is judged by how a model maintains its prediction in presence of adversarial text.

The experiment design takes into account (a) Text addition method, (b) Models, and, (c) Datasets.

Text addition can be random tokens, wikipedia sentences, or, specifically adversarial. Models can either just use the full context, have rationalizer modules, or supplemented.

Robustness eval has 2 metrics: gold rationale, the equivalence to human rationale &, attack capture rate, efficiency at masking of attack information. 

Models have different performance drops for different datasets, different adversarial additions & position of addition.

In summary, 
(a) full context models are significantly less robust than those with rationalizer modules, 
(b) position of adversarial text insertion matters, 
(c) supplemented models maybe less robust, and, 
(d) efficient masking implies improved performance.

Graphical Abstract for "Can Rationalization Improve Robustness?"

As I mentioned before, I am really glad to be able to merge my love for NLP with  that of sketchnoting for science communication.

Explanations can either match or be on odds with any user's mental model. A good explanation should be truthful, have no missing reasonings, and account for the users' mental models.

Saliency, tuple & concepts are the main explanation types used, though, counterfactual explanations are preferred. Humans decide explanation goal, judge sensibility, &, develop mental models.

Mental models, amongst other things, should be personal, evolving & contrastive.

When comparing the explanation to the LLM's behavior, we either end up with high or low fidelity explanations. Depending on the alignment with a user's mental model, a person can leave with either a truthful understanding, an untruthful understanding, or no understanding.

One of the main aims of any model explanation decision, should be supporting mental model calibration through: (a) no false generalization, (b) human-like explanations, (c) catch pitfalls, (d) contrastive explanations, (e) adaptive process, and, (f) collaborative learning.

Graphical Abstract: Beware the Rationalization Trap! When Language Model Explainability Diverges from our Mental Models of Language

I made this account to finally get around to merging my three interests, empirical evaluation in NLP, character design, &amp;, science communication. Over the next month, I plan to upload 2 infographic posters for a paper every week. Would love to know community's opinion of them :)
